Unit Testing with Pytest

This tutorial shows how to use LangSmith datasets to write unit tests directly in your pytest test suite. This lets you write assertions on the chain output in a familiar pythonic way while still maintaining organized test projects and traces in LangSmith, which help maintain a record of all the predictions by data point as your chain evolves.

Note: This recipe shows how to unit test individual rows, where the test suite will fail if ANY assertion fails. Now let's get started!


Create a virtual environment and install the dependencies in requirements.txt.

Make sure you have signed up for LangSmith and have set a functioning API key in your environment variable:

The chain we are using is built with Anthropic. The cot_qa evaluator used in one of the tests by default uses gpt-4. Make sure to configure your api keys for this:

Next, prepare the test data. Run the following to upload two datasets to LangSmith:


For this tutorial, we will test a chain made of a simple prompt template + LLM. This chain classifies a loan request for a person with a provided desription, deciding whether to pre-approve, reject, or request more information about a person before deciding. Each dataset has inputs that are made-up descriptions of people.s

Note: This chain is for instructional purposes only. It's not recommended to use LLM's directly for high-stakes decision making, as should be evidenced by the failed test cases in this example.

To run the tests, run

python -m pytest

We designed this so some of these fail! You will likely see output that looks something like the following:

You can review the results by navigating to the entity dataset page and clicking on one of the "Person Entities" or "Org Entities" datasets. The test run(s) and their aggregate feedback is visible there. If you click trough, you can see the inputs and outputs for each row saved to LangSmith, along with the chain traces.

The example below shows that one of the results failed.

Now that you've run the tests, let's check out the code.

Code Walkthrough

Let's review, where the tests are defined. These are meant to be loose references for a couple of ways to evaluate your model in CI. First, we define the chain to be tested in the pytest fixture. Its prompt and model structure as as follows:

In this case, we are using LangChain's runnables to compose the prompt and a Claude-2 model from Anthropic. Since this is a pytest fixture, it will be called for each unit test by default.

Now it's time to define the tests!

The tests in this recipe show how you can directly unit test your LLMs and chains using LangSmith datasets. If any test case fails, the entire test suite does as well, so these are best applied to simple functionality tests you know the chain should never fail. The main benefit of this approach is one of ergonomics: you get to write pass/fail criteria on a data-point level without having to learn any LangChain-specific terminology.

The code is below:

This test uses a custom decorator @langsmith_unit_test(&lt;dataset-name&gt;) defined in that uses pytest to parametrize the test case with the example and callbacks config for each row in the dataset. It also automatically logs the pass/fail criteria based on the result of the test. All assertion errors are logged as failing feedback in LangSmith. This lets you easily define test cases without having to define a custom evaluator.

If you wanted to unit test an async method of the chain, you could modify the test case to look something like the following:

This uses pytest-asyncio to mark the test as @pytest.mark.asyncio. The mark ought to be placed outside the decorator to guarantee that pytest recognizes it as a test case.


Congratulations! You now have integrated LangSmith directly in your pytest workflow so that you can regularly unit test your chains and prompts. You can view the resulting traces for each test run to debug any failing tests and compare runs across chain versions.

Unit testing actual LLM calls has its place on baseline functionality testing, but it can become noisy if not done selectively. The input domain of most LLM apps is large enough that it's impossible to write individual unit tests to check every edge case. If you can narrow down the input space to be able to unit test it exhaustively, it's likely an LLM isn't necessary for the task you're trying to accomplish.
